AI Platform for Predictive Sales Analytics: XGBoost on Databricks

Sales forecasts built in spreadsheets struggle with seasonality, promotions and changing demand. This paper describes a governed AI platform on Databricks that uses XGBoost to produce accurate, explainable sales predictions in production.

1Challenge

  • Inaccurate forecasts: manual, spreadsheet-based methods miss seasonality, price effects and regional patterns, causing stock-outs and excess inventory.
  • Data in silos: sales, pricing, promotion and external data live in separate systems.
  • Pilots that stall: notebook experiments never reach production because there's no repeatable way to deploy, monitor or retrain models.
  • Trust & governance: planners won't act on 'black-box' predictions, and data must stay secure.

Platform architecture

  1. Lakehouse foundation

Sales, product, pricing, promotion, calendar and external data (such as holidays or weather) are ingested into Delta Lake tables in bronze, silver and gold layers, governed by Unity Catalog.

  2. Feature engineering

Reusable features (lags, rolling averages, seasonality indicators, price elasticity signals, promotion flags) are built with Spark and published to a feature table for consistent training and scoring.

  3. Model training with XGBoost

Gradient-boosted tree models are trained with XGBoost (distributed across the cluster where needed), with time-aware cross-validation and hyperparameter tuning (Hyperopt/Optuna).

  4. MLOps with MLflow

Every experiment, parameter and metric (MAPE, RMSE, bias) is tracked. Models are versioned in the registry and promoted through staging to production with approval gates.

  5. Scoring & delivery

Scheduled batch jobs produce forecasts by product, region and week, published to gold tables and into Power BI and planning tools.

  6. Explainability & monitoring

SHAP values explain each forecast's drivers, and drift and accuracy monitoring trigger retraining when performance slips.

Security by design: fine-grained access controls, private networking, secrets management and audit logging keep sensitive commercial data protected throughout the ML lifecycle.

3Results

More accurate forecasts

Machine-learning models capture seasonality, promotions and regional effects that manual methods miss.

Better inventory decisions

Improved forecasts help reduce both stock-outs and excess inventory.

Explainable predictions

SHAP-based driver analysis builds planner trust and supports adoption.

Production-grade MLOps

Automated retraining and monitoring keep models accurate as markets change.
